Detail Description

1. Abstract

Audio Deepfake Detection is an AI-based system designed to identify whether an audio recording contains genuine human speech or artificially generated or manipulated speech. The system analyzes audio characteristics, speech patterns, spectral features, and other acoustic properties to distinguish real recordings from synthetic or cloned voices. Machine learning and deep learning algorithms are used to classify audio samples as real or fake. This project helps address the growing risks of voice impersonation, audio fraud, misinformation, and unauthorized voice cloning. It can be applied in cybersecurity, digital forensics, fraud prevention, and secure communication systems.

2. Objectives

  1. To develop an AI-based system for detecting fake and synthetic audio.
  2. To distinguish genuine human speech from AI-generated or manipulated speech.
  3. To extract relevant acoustic and spectral features from audio recordings.
  4. To train machine learning or deep learning models for audio classification.
  5. To evaluate model performance using suitable classification metrics.
  6. To support the detection of voice-based fraud and audio impersonation.

3. Existing System

Traditional methods of audio verification often depend on manual listening, expert analysis, or basic signal-processing techniques. These methods can be time-consuming and may fail to detect sophisticated synthetic voices generated by modern AI systems. Some existing detection systems are designed for specific datasets or generation methods and may not perform reliably on unfamiliar voices, languages, compression formats, or recording conditions.

Disadvantages of the Existing System

  1. Manual verification is time-consuming.
  2. Synthetic voices can closely resemble genuine human speech.
  3. Basic detection methods may fail to identify advanced voice cloning.
  4. Background noise and audio compression can affect detection accuracy.
  5. Models trained on limited datasets may not generalize well to unseen audio.

4. Proposed System

The proposed system uses machine learning or deep learning techniques to analyze uploaded audio recordings and predict whether they are real or fake. The audio is preprocessed and converted into useful representations, such as Mel spectrograms or Mel-Frequency Cepstral Coefficients (MFCCs). These features are provided to a trained classification model that identifies patterns associated with genuine and synthetic speech. The application displays the predicted class and, if supported, a confidence score.

Key Features

  1. Audio file upload for analysis.
  2. Support for common audio formats such as WAV and MP3, depending on implementation.
  3. Audio preprocessing and feature extraction.
  4. AI-based real-versus-fake classification.
  5. Display of prediction results and optional confidence scores.
  6. User-friendly interface for testing audio samples.
  7. Potential integration into digital forensics and security applications.

5. Implementation Procedure

  1. Dataset Collection: Collect genuine and synthetic audio samples from suitable datasets, such as ASVspoof or other appropriately licensed deepfake audio datasets.
  2. Audio Preprocessing: Load recordings, standardize sampling rates, convert channels when required, and handle silence or noise.
  3. Feature Extraction: Extract features such as MFCCs, spectrograms, spectral characteristics, and other relevant audio representations.
  4. Dataset Preparation: Label audio samples as real or fake and divide them into training, validation, and testing sets. Avoid placing recordings from the same speaker across different splits when possible.
  5. Model Selection: Select a suitable model, such as Random Forest, Support Vector Machine, CNN, or a pretrained audio model.
  6. Model Training: Train the selected model using labeled audio data to identify patterns associated with synthetic speech.
  7. Model Evaluation: Evaluate performance using accuracy, precision, recall, F1-score, confusion matrix, and suitable detection metrics such as Equal Error Rate where appropriate.
  8. Application Development: Build a web interface using Flask or Streamlit for uploading and analyzing audio.
  9. Prediction: Process new audio samples and display the predicted class along with an optional confidence score.
  10. Testing: Test the system with different speakers, audio quality levels, synthesis methods, and unseen samples to assess generalization.
