Early Warning System for At-Risk Students
Abstract
Early Warning System for At-Risk Students is a machine learning-based system designed to identify students who may require academic or institutional support at an early stage. The system analyzes factors such as attendance, academic performance, assignment completion, examination results, engagement, and previous academic records to detect potential risk patterns. Machine learning models can classify students according to their risk level and provide early insights to educators, enabling timely support and intervention.
Objectives
- Develop an early warning system for identifying at-risk students.
- Analyze academic, attendance, and engagement-related factors.
- Detect early indicators of academic difficulty.
- Predict student risk levels using machine learning.
- Provide timely alerts to authorized educators or administrators.
- Support targeted academic intervention and mentoring.
- Reduce manual monitoring of large student populations.
- Improve student-support and retention strategies.
Existing System
In traditional educational institutions, at-risk students are generally identified through attendance records, examination results, faculty observations, and manual academic reviews.
Disadvantages:
- Manual monitoring is time-consuming.
- Difficult to continuously monitor large numbers of students.
- Early warning signs may be missed.
- Multiple risk factors may not be analyzed together.
- Historical data may not be fully utilized.
- Intervention may occur only after academic performance has already declined.
Proposed System
The proposed system uses machine learning to analyze student academic and behavioral data and identify potential risk patterns. Factors such as attendance, grades, assignment completion, failed subjects, assessment scores, engagement, and academic history can be analyzed.
Classification models such as Logistic Regression, Decision Tree, Random Forest, KNN, SVM, and Gradient Boosting can be evaluated. The system can categorize students into predefined risk levels such as Low, Medium, or High Risk, based on the training data and configured criteria.
A Streamlit or Flask dashboard can provide authorized educators with student risk indicators, trends, and relevant supporting information.
Implementation Procedure
- Data Collection – Collect student academic, attendance, assessment, and engagement data.
- Data Preprocessing – Handle missing values, duplicates, outliers, and inconsistent records.
- Exploratory Data Analysis – Identify patterns associated with academic risk.
- Feature Engineering – Create relevant indicators such as attendance percentage and assessment trends.
- Feature Selection – Select important variables for prediction.
- Data Splitting – Divide the dataset into training and testing sets.
- Model Training – Train multiple classification algorithms.
- Model Evaluation – Evaluate using accuracy, precision, recall, F1-score, ROC-AUC, and confusion matrix.
- Risk Classification – Generate risk categories according to the trained model.
- Alert Generation – Display appropriate warnings for students identified as potentially at risk.
- Dashboard Development – Build student and administrator/educator dashboards.
- Testing and Deployment – Test with sample student records and deploy for authorized institutional use.
